Transform ‘Dark Data’ from Documents with Document AI, Cloud Functions and Workflows

At enterprises across industries, documents are at the center of core business processes. Documents store a treasure trove of valuable information whether it’s a company’s invoices, HR documents, tax forms and much more. However, the unstructured nature of documents make them difficult to work with as a data source. We call this “dark data” or unstructured data that businesses collect, process and store but do not utilize for purposes such as analytics, monetization, etc. These documents in pdf or image formats, often trigger complex processes that have historically relied on fragmented technology and manual steps. With compute solutions on Google Cloud and Document AI, you can create seamless integrations and easy to use applications for your users. Document AI is a platform and a family of solutions that help businesses to transform documents into structured data backed by machine learning. In this blog post we’ll walk you through how to use Serverless technology to process documents with Cloud Functions, and with workflows of business processes orchestrating microservices, API calls, and functions, thanks to Workflows.
At Cloud Next 2021, we presented how to build easy AI-powered applications with Google Cloud. We introduced a sample application for handling incoming expense reports, analyzing expense receipts with Procurement Document AI, a DocAI solution for automating procurement data capture from forms including invoices, utility statements and more. Then organizing the logic of a report approval process with Workflows, and used Cloud Functions as glue to invoke the workflow, and do analysis of the parsed document.

We also open sourced the code on this Github repository, if you’re interested in learning more about this application.

In the above diagram, there are two user journeys: the employee submitting an expense report where multiple receipts are processed at once, and the manager validating or rejecting the expense report.
First, the employee goes to the website, powered by Vue.js for the frontend progressive JavaScript framework and Shoelace for the library of web components. The website is hosted via Firebase Hosting. The frontend invokes an HTTP function that triggers the execution of our business workflow, defined using the Workflows YAML syntax.
Workflows is able to handle long-running operations without any additional code required, in our case we are asynchronously processing a set receipt files. Here, the Document AI connector directly calls the batch processing endpoint for service. This API returns a long-running operation: if you poll the API, the operation state will be “RUNNING” until it has reached a “SUCCEEDED” or “FAILED” state. You would have to wait for its completion. However, Workflows’ connectors handle such long-running operations, without you having to poll the API multiple times till the state changes. Here’s how we call the batch processing operation of the Document AI connector:

Machine learning uses state of the art Vision and Natural Language Processing models to intelligently extract schematized data from documents with Document AI. As a developer, you don’t have to figure out how to fine tune or reframe the receipt pictures, or how to find the relevant field and information in the receipt. It’s Document AI’s job to help you here: it will return a JSON document whose fields are: line_item, currency, supplier_name, total_amount, etc. Document AI is capable of understanding standardized papers and forms, including invoices, lending documents, pay slips, driver licenses, and more.
A cloud function retrieves all the relevant fields of the receipts, and makes its own tallies, before submitting the expense report for approval to the manager. Another useful feature of Workflows is put to good use: Callbacks, that we introduced last year. In the workflow definition we create a callback endpoint, and the workflow execution will wait for the callback to be called to continue its flow, thanks to those two instructions:

In this example application, we combined the intelligent capabilities of Document AI to transform complex image documents into usable structured data, with Cloud Functions for data transformation, process triggering, and callback handling logic, and Workflows enabled us to orchestrate the underlying business process and its service call logic.

When it comes to the adoption of artificial intelligence (AI), we have reached a tipping point. Technologies that were once accessible to only a few are now broadly available. This has led to an explosion in AI investment. However, according to research firm McKinsey, for AI to make a sizable contribution to a company’s bottom line, they “must scale the technology across the organization, infusing it in core business processes” — and based on conversations with our customers, we couldn’t agree more.
While investments in pure data science continue to be essential for many, widespread adoption of AI increasingly involves a category of applications and services that we call AI agents. These are technologies that let customers apply the best of AI to common business challenges, with limited technical expertise required by employees, and include Google Cloud products like Document AI and Contact Center AI. Today, at Google Cloud Next ‘22, we’re announcing new features to our existing AI agents and a brand new one with Translation Hub.
“AI is becoming a key investment for many companies’ long term success. However, most companies are still in the experimental phases with AI and haven’t fully put the technology into production because of long deployment timelines, IT staffing needs, and more,” said Ritu Jyoti, group vice president, worldwide AI and automation research practice global AI research lead, at IDC. “Organizations need AI products that can be immediately applied to automate processes and solve business problems. Google Cloud is answering this problem by providing fully managed, scalable AI agents that can be deployed fast and deliver immediate results.”
Translation Hub: An enterprise-scale translation AI agent
At I/O this year, we announced the addition of 24 new languages to Google Translate to allow consumers in more locations, especially those whose languages aren’t represented in most technology, to help reduce communication barriers through the power of translation. Businesses strive for the same goals, but unfortunately it is often out of reach due to the high costs that come with scaling translation.
That’s why today, we are announcing Translation Hub, our AI agent that provides customers with self-service document translation. With 135 languages, Translation Hub can create impactful, inclusive, and cost-effective global communications in a few clicks.

With Translation Hub, now researchers are able to share their findings instantly across the world, goods and services providers can reach underserved markets, and public sector administrators can reach more members of their communities in a language they understand — all of which ultimately help make for a more connected, inclusive world.
Translation Hub brings together Google Cloud AI technology, like Neural Machine Translation and AutoML, to help make it easy to ingest and translate content from the most common enterprise document types, including Google Docs and Slides, PDFs, and Microsoft Word. It not only preserves layouts and formatting, but also provides granular management controls such as support for post-editing human-in-the-loop feedback and document review.
“In just three months of using Translation Hub and AutoML translation models, we saw our translated page count go up by 700% and translation cost reduced by 90%,” said Murali Nathan, digital innovation and employee experience lead, at materials science company Avery Dennison. “Beyond numbers, Google’s enterprise translation technology is driving a feeling of inclusion among our employees. Every Avery Dennison employee has access to on-demand, general purpose, and company-specific translations. English language fluency is no longer a barrier, and our employees are beginning to broadly express themselves right in their native language.”
Document AI: A document processing AI agent to automate workflows
Every organization needs to process documents, understand their content, and make them available to the appropriate people. Whether it’s during procurement cycles involving invoices and receipts, contract processes to close deals, or for general increases in efficiency, Document AI simplifies and automates various document processing. With two new features launching today, Document AI can allow employees to focus on higher impact tasks and better serve their own customers.
For example, payments provider Libeo used Document AI to uptrain an invoice parser with 1,600 documents and increase its testing accuracy from 75.6% to 83.9%. “Thanks to uptraining, the Document AI results now beat the results of a competitor and will help Libeo save ~20% on the overall cost for model training over the long run,” said Libeo chief technology officer, Pierre-Antoine Glandier.
Today, we’re announcing these new features to our existing Document AI agent:
- Document AI Workbench can remove the barriers around building custom document parsers, helping organizations extract fields of interest that are specific to their business needs. Relative to more traditional development approaches, it requires less training data and offers a simple interface for both labeling data and one-click model training.
- Document AI Warehouse can eliminate the challenges that many enterprises face when tagging and extracting data in documents by bringing Google’s Search technologies to Document AI. This feature can make it simpler and easier to search for and manage documents like workflow controls to accommodate invoice processing, contracts, approvals, and custom workflows.
Contact Center AI: A contact center AI agent to improve customer experiences
Scaling call center support can be expensive and difficult, especially when implementing AI technologies to support representatives. Contact Center AI is an AI agent for virtually all contact center needs, from intelligently routing customers, to facilitating handoffs between virtual and human customer support representatives, to analyzing call center transcripts for trends and much more.
Just days ago, we announced that Contact Center AI Platform is now generally available to provide additional deployment choice and flexibility. With this addition to Contact Center AI, we are furthering our commitment to providing an AI agent that can assist organizations to quickly scale their contact centers to improve customer experiences and create value via data-driven decisions.

SEED: The 4 Areas of a Well-functioning and Responsible AI

The future of AI is better AI—designed with ethics and responsibility built in from the start. This means putting the brakes on AI-driven transformation until you have a well-functioning strategy and process in place to ensure your models deliver fair outcomes. Failing to recognize this imperative is a threat to your bottom line. The following post provides a simple framework to follow to keep your business on the right track as you place more trust in algorithms.
AI is inherently sociotechnical. AI systems represent the interconnectedness of humans and technology. They are designed to be used by and to inform humans within specific contexts, and the speed and scale of AI means that any lack of responsibility—such as bias, safety, privacy, scientific excellence etc—will also replicate at that same speed and scale. Without ethics and responsibility built in by design, AI systems lack the critical “inputs” or societal context that enable long term success.
Lawsuits stemming from AI systems that are biased towards certain groups are stacking up. In August 2020, IBM was forced to settle a lawsuit with the city of Los Angeles for misappropriating data it collected for its weather channel app. Health services company, Optum, is being investigated by regulators for creating an algorithm that allegedly recommended that doctors and nurses pay more attention to white patients than to sicker black patients. And Facebook, which granted Cambridge Analytica, a political firm, access to the personal data of more than 50 million people, is buried in legal work. Google has also run into its share of issues with algorithms making egregious mistakes.
While lawsuits are real, the foundational reason ethical AI is critical to your bottom line is trust. Without it, increasingly, consumers will ignore you and choose a brand they do trust. Research from Kantar, which runs one of the largest global brand equity studies (4 million consumers, 18,000 brands, across 50 markets), revealed that almost 9% of a brand’s equity is driven by corporate reputation, of which responsibility is a key attribute. Over the last decade, the importance of responsibility to consumers in relation to making brand choices has tripled.
The study stated brands perceived to be among the world’s most trusted and responsible shared three crucial factors that proved particularly important for building consumer trust and confidence, even when a brand might be new to a market. These are:
- Honesty and openness
- Respect and inclusion
- Identifying with and caring for customers
Brands that develop these associations more strongly tend to outperform their competitors in defending and growing their brand value.

Technology and business leaders need to focus on four areas to accomplish a well-functioning ethical AI strategy. Lopez Research refers to this group of tasks as SEED, which stands for security, ethics, explainability, and data (SEED). Each of these topics could be an article in itself, but this post will define several essential components.
SECURITY (S)
It might not seem obvious, but a robust AI strategy requires an embedded security strategy. Companies should look for hardware-level security in components such as GPUs and CPUs. IT leaders should build software security into models to minimize attacks such as poisoning, evasion, deepfakes, backdoors, and model extraction. The threat of adversarial data poisoning attacks machine learning models by maliciously introducing inaccurate data designed to corrupt the model’s ability to be accurate. Another security threat is model extraction, also known as model cloning, where a hacker finds a way to either reconstruct a black-box machine learning model or extract the training data. The first line of defense against all security attacks is to design security at the outset, but the next best step is to frequently test models to ensure they are operating as planned. Business leaders, data science experts, and IT leaders must work together to regularly review the outcomes of AI models.
ETHICS (E)
Today, organizations must understand that ethics should be designed into the solution at its outset. The ethics process starts with defining the potential positive and negative outcomes of the model that your business is creating. Once the team has evaluated potential harmful effects, which means unpacking the systems, beliefs, power hierarchies and dynamics that interconnect with the technology, it’s your responsibility to eliminate or minimize the impact of these outcomes. It’s also critically important to review the impact of models in production and shut down models demonstrating issues. An example of this was the public beta release of the Tay chatbot that Microsoft deployed and rapidly shut down because it propagated negative biases.
Yet, many organizations aren’t taking this action. The FICO study revealed that 93% of companies said responsible AI was critical for success but only 33% of these companies were measuring AI model outputs to ensure these models were operating as expected (measuring for model drift). Another survey by Pew Research revealed that 68% believe that ethical principles focused primarily on the public good will not be employed in most AI systems by 2030.
Regulations may turn this tide, regardless of whether organizations plan to adopt an ethical AI framework. Laws governing the ethical use of data in AI are expected to be finalized as soon as 2022, such as the European Commission’s proposed legal framework for AI. Organizations that start with ethical use of AI in mind will be better positioned to deal with customer privacy concerns and regulatory compliance.
EXPLAINABILITY(E)
As models have become more sophisticated, it’s also become increasingly difficult to explain why a model created a specific outcome. In the FICO Responsible AI report, 65% of respondents could not explain how specific AI model decisions or predictions are made, and only 35% said their organization made an effort to use AI in a way that was transparent and accountable. However, it’s never been more important to clarify how AI models came to conclusions such as why a loan was denied, why a particular strategy should be implemented, and how AI selected a set of resumes to review for a position. The goal is to create an explainable AI model from the outset but many of today’s models lack this capability. Every business should review its existing models and use open-source toolkits that can be found on Github.com that support the interpretability and explainability of machine learning models.
Keep in mind that explainability isn’t one-size-fits-all. Different stakeholders need different types of information. Much of explainability to date has focused on “opening the black box” which gets equated to information that is only useful for other data scientists. That’s important, but it doesn’t help the line of business users whose workflows AI is integrated into, or end users who deserve information about how decisions are made; or policymakers who don’t have data science backgrounds, and so on.
DATA (D)
An equally important item in ethics is data. Ethics starts with ensuring you have the correct data to create and update models. Three main issues include representative data, inherent biases within existing data, and inaccurate data. A critical issue that most companies miss in creating models is that current data sets frequently lack full market representation. A recent Capgemini Research Institute report revealed that 65% of executives “were aware of the issue of discriminatory bias” with these systems.
Awareness is the first step, but organizations must take action to remedy this issue. Historical data may no longer serve a company’s current needs for model creation. Historical records may contain biases against certain groups. For example, historical criminal data records show an imbalance in ethnic groups’ incarceration, which would lead to model biases. Additionally, laws and societal norms also change. Certain groups were prosecuted for sexual preference in the past, but today this information would create an inaccurate model.
Companies have also discovered that using demographic data, a common practice in marketing, can also lead to model bias. For example, individuals that primarily used cash for transactions and others that lived in specific zip codes were at a disadvantage in banking models to determine creditworthiness. To minimize these issues, a company needs to augment its data with full representation in areas such as ethnicity, gender, age, behavioral and economic profiles.

Design AI models with a continuous feedback loop
Another, more prominent, yet tricky issue is data accuracy. As the adage says, garbage in, equals garbage out. The least appreciated but arguably the most essential component of the AI model lifecycle is ensuring the model has accurate data at all times. Inaccurate data from either poor data hygiene or data that was tampered with for security purposes can cause model failures. Organizations need to invest the time and resources to ensure they have the correct data. Data privacy is another key element that businesses must address, but the concepts of data privacy, sovereignty, and security are significant enough that we will come back to this in a separate article.
Overall, it’s clear that while we may have an abundance of data, it most likely doesn’t represent what we want to model for the future. A successful AI strategy is an ethical AI strategy that requires the organization to be thoughtful in its model creation by ensuring it has a broad representation of accurate data and testing the outcomes to ensure the models are secure and operating as expected.
Organizations that define an AI model lifecycle with a continuous feedback loop will reap the benefits of better intelligence. This will increasingly mean stronger, longer lasting trust with customers and staying on the right side of new laws and regulations.

Google Cloud’s Recommendation AI Helps Bazaarvoice with 60 Percent increase in CTR

Not long ago, building AI into recommendation engines was a daunting, expensive task that could take years to get off the ground. But as Bazaarvoice has shown, with the help of cloud services, the time from AI investment to business outcomes is shorter than ever.
Bazaarvoice is the leading provider of product reviews and user-generated content (UGC) solutions that help brands and retailers understand and better serve customers. Its 2019 acquisition of Influenster.com, a community of consumer reviewers 6.5 million strong, expanded the Bazaarvoice portfolio with a platform where consumers can share their candid opinions — and share they have, over 54 million times.
After the acquisition, Bazaarvoice expanded the site’s product diversity by 53%, to more than 5.4 million unique products. To keep user engagement high, Influenster must be seen as both a source of trusted, transparent reviews and a place for customers to discover useful, relevant products for the first time. By introducing shoppers to new products Influenster not only provides value to customers but also helps brands collect consumer insights.
Influenster started out as a place where people gathered to share their honest thoughts on beauty products but quickly expanded to nearly every category, from Art to Wearables. Because of the much smaller scope, the site started and flourished under a rules-based recommendation engine. However, as Influenster expanded its scope under Bazaarvoice, a more robust recommendation system became necessary. In its earliest days, Influenster was successful because of the human perspective it offered: For every product there was a litany of reviews and images that made users feel as if they were getting an endorsement on a product from a friend.
The Bazaarvoice engineering team asked themselves how they could keep that same feeling of personalization with an ever-growing catalog of items and categories. They needed recommendations that could scale with the site, rather than requiring more rules be constructed each time a new product category was introduced. They also needed to ensure the Influenster experience would remain performant even towards unknown members.
Bazaarvoice tested out several recommendation engines, benchmarking each against their current rules-based system. In the end they decided on Google Cloud’s Recommendations AI because of its transparent billing, ease of integration and setup, and naturally, its proven results.
Transparent Billing
“Part of what the engineers loved was they knew exactly what it was going to cost as it scaled” says Nick Shiftan, SVP, Content Acquisition Services Product Unit for Influenster. The goal was to build once and innovate rather than leave a wake of technical debt only to be tackled when costs grew unexpectedly out of control. Google Cloud’s straightforward and pay-as-you-go billing allowed them to anticipate how costs would grow as user interactions did and plan accordingly.
Ease of integration

“I’m positively surprised how Google packed such a complex system in a very easy-to-use API” remarks Eralp Bayraktar, the Software Engineering team lead overseeing the project. Because the original team was made of just one full-time engineer the ease of integration became an even more critical feature. Not only does Recommendations AI pull from years of suggestion expertise in Google Search and YouTube, but in combination with Ad’s Merchant Center, it also creates a streamlined process for importing product metadata. From there, creating a model becomes a matter of picking the preferred recommendation type and then the business objective to optimize for. Once the model is created and the API integrated into the website, the code is already deployed at the global scale: There are no further architectural considerations to ensure recommendations are available to users worldwide. For Bazaarvoice, this meant going from ideation to production in one month.
Proven Results
“We have used it for product recommendations and off-loaded our DB-tiring business logic to Recommendations AI, which resulted in overall faster response times and much better recommendations as proven by our A/B tests,” Eralp continues.
Bazaarvoice began by A/B testing Recommendations AI against their rules-based system. Early on in the experimental phase they noticed a clear and consistent 60% increase in the click-through rate over their original recommendation system.
Even more impressive was the performance on Unknown Members. For every person that signs up for an account on Influenster.com there are many other visitors that come to the website and leave without fully registering. This is typically referred to as the “cold start” problem in the industry — how do you figure out what to recommend to those people without their history, behavior, or preferences? Recommendations AI gives you the option to input and train on unknown users, and by providing metadata on products, it can provide high-quality suggestions to registered members and first-time users alike.
With a mind to the future, Eralp concludes his thoughts on Bazaarvoice’s experience: “It enables discovery by adding an adjustable percentage of cross-category products [for] healthier [traffic distribution] across all our catalog. We are investing in data science and having the Recommendations AI as the baseline is a good challenge for us to thrive.”
